Abstract

Hyperspectral unmixing aims at identifying a set of elementary spectra and the corresponding mixture coefficients for each pixel of an image. As the elementary spectra correspond to the reflectance spectra of real materials, they are often very correlated yielding an ill-conditioned problem. To enrich the model and to reduce ambiguity due to the high correlation, it is common to introduce spatial information to complement the spectral information. The most common way to introduce spatial information is to rely on a spatial regularization of the abundance maps. In this paper, instead of considering a simple but limited regularization process, spatial information is directly incorporated through the newly proposed context of spatial unmixing. Contextual features are extracted for each pixel and this additional set of observations is decomposed according to a linear model. Finally the spatial and spectral observations are unmixed jointly through a cofactorization model. In particular, this model introduces a coupling term used to identify clusters of shared spatial and spectral signatures. An evaluation of the proposed method is conducted on synthetic and real data and shows that results are accurate and also very meaningful since they describe both spatially and spectrally the various areas of the scene.

Abstract

Supervised classification and representation learning are two widely used classes of methods to analyze multivariate images. Although complementary, these methods have been scarcely considered jointly in a hierarchical modeling. In this paper, a method coupling these two approaches is designed using a matrix cofactorization formulation. Each task is modeled as a factorization matrix problem and a term relating both coding matrices is then introduced to drive an appropriate coupling. The link can be interpreted as a clustering operation over a low-dimensional representation vectors. The attribution vectors of the clustering are then used as features vectors for the classification task, i.e., the coding vectors of the corresponding factorization problem. A proximal gradient descent algorithm, ensuring convergence to a critical point of the objective function, is then derived to solve the resulting non-convex non-smooth optimization problem. An evaluation of the proposed method is finally conducted both on synthetic and real data in the specific context of hyperspectral image interpretation, unifying two standard analysis techniques, namely unmixing and classification.

Abstract

Within a supervised classification framework, labeled data are used to learn classifier parameters. Prior to that, it is generally required to perform dimensionality reduction via feature extraction. These preprocessing steps have motivated numerous research works aiming at recovering latent variables in an unsupervised context. This paper proposes a unified framework to perform classification and low-level modeling jointly. The main objective is to use the estimated latent variables as features for classification and to incorporate simultaneously supervised information to help latent variable extraction. The proposed hierarchical Bayesian model is divided into three stages: a first low-level modeling stage to estimate latent variables, a second stage clustering these features into statistically homogeneous groups and a last classification stage exploiting the (possibly badly) labeled data. Performance of the model is assessed in the specific context of hyperspectral image interpretation, unifying two standard analysis techniques, namely unmixing and classification.

Abstract

Metallic implants are frequently used in medicine to support and replace degenerated tissues. Implant loosening due to particle exposure remains a major cause for revision arthroplasty. The exact role of metal debris in sterile peri‐implant inflammation is controversial, as it remains unclear whether and how metals chemically alter and potentially accumulate behind an insulating peri‐implant membrane, in the adjacent bone and bone marrow (BM). An intensively focused and bright synchrotron X‐ray beam allows for spatially resolving the multi‐elemental composition of peri‐implant tissues from patients undergoing revision surgery. In peri‐implant BM, particulate cobalt (Co) is exclusively co‐localized with chromium (Cr), non‐particulate Cr accumulates in the BM matrix. Particles consisting of Co and Cr contain less Co than bulk alloy, which indicates a pronounced dissolution capacity. Particulate titanium (Ti) is abundant in the BM and analyzed Ti nanoparticles predominantly consist of titanium dioxide in the anatase crystal phase. Co and Cr but not Ti integrate into peri‐implant bone trabeculae. The characteristic of Cr to accumulate in the intertrabecular matrix and trabecular bone is reproducible in a human 3D in vitro model. This study illustrates the importance of updating the view on long‐term consequences of biomaterial usage and reveals toxicokinetics within highly sensitive organs., Spatially micron‐ and nanoresolved synchrotron X‐ray fluorescence analyses of peri‐implant cancellous bone reveal specific distribution and accumulation patterns of metals released from alloys frequently used in knee and hip arthroplasty. These new insights of the local toxicokinetics of metallic debris prove that cobalt, chromium, and titanium exposure also occurs behind the insulating implant membrane, in the bone and bone marrow.

Abstract

Numerous frameworks have been developed in order to analyze the increasing amount of available image data. Among those methods, supervised classification has received considerable attention leading to the development of state-of-the-art classification methods. These methods aim at inferring the class of each observation given a specific class nomenclature by exploiting a set of labeled observations. Thanks to extensive research efforts of the community, classification methods have become very efficient. Nevertheless, the results of a classification remains a highlevel interpretation of the scene since it only gives a single class to summarize all information in a given pixel. Contrary to classification methods, representation learning methods are model-based approaches designed especially to handle high-dimensional data and extract meaningful latent variables. By using physic-based models, these methods allow the user to extract very meaningful variables and get a very detailed interpretation of the considered image. The main objective of this thesis is to develop a unified framework for classification and representation learning. These two methods provide complementary approaches allowing to address the problem using a hierarchical modeling approach. The representation learning approach is used to build a low-level model of the data whereas classification is used to incorporate supervised information and may be seen as a high-level interpretation of the data. Two different paradigms, namely Bayesian models and optimization approaches, are explored to set up this hierarchical model. The proposed models are then tested in the specific context of hyperspectral imaging where the representation learning task is specified as a spectral unmixing problem

Abstract

La classification supervisée et le démélange spectral sont parmi les techniques les plus utilisées pour extraire l’information d’images hyperspectrales. Elles abordent cependant ce problème sur des bases différentes et n’ont été que rarement envisagées conjointement. Nous proposons dans ce papier un modèle de cofactorisation de matrices permettant de lier ces approches. Chaque problème est formulé comme un problème de factorisation de matrices puis un terme de couplage est introduit. Ce terme s’interprète comme une étape de partitionnement où les vecteurs d’abondances sont séparés en plusieurs groupes puis les vecteurs d’attribution aux groupes sont utilisés comme vecteurs de descripteurs pour la classification. Le problème global de cofactorisation s’écrit finalement comme un problème d’optimisation non-convexe et non-lisse dont on obtient une solution approchée à l’aide d’un algorithme de minimisation proximale linéarisée alternée (PALM) garantissant la convergence vers un point critique. L’intérêt du modèle est illustré par des expériences menées sur des données semi-synthétiques réalistes.

Abstract

L’interprétation des images hyperspectrales demeure un problème complexe qui a été abordée sous différents paradigmes. En particulier, les techniques de classification supervisée et de démélange spectral sont deux familles de méthodes d’interprétation largement utilisées. Ces deux approches offrent des analyses complémentaires : le démélange spectral propose une modélisation basée sur une interprétation physique des images hyperspectrales, en supposant que chaque pixel est un mélange de spectres purs associés aux divers matériaux présents dans la scène, tandis que la classification supervisée cherche à identifier une classe unique par pixel en se basant sur un ensemble de classes sémantiques définies par l’utilisateur et sur un ensemble de données, labellisées par un expert, lui servant d’exemple. Si ces deux techniques ont été largement discutées dans la littérature, elles ont été rarement utilisées conjointement.

Abstract

La classification supervisée et le démélange spectral sont deux techniques permettant d’extraire de l’information d’images hyperspectrales. Cependant, malgré la complémentarité de ces techniques, il est rare de trouver des travaux les exploitant conjointement. Nous proposons donc un nouveau modèle bayésien hiérarchique pour mener de façon conjointes ces deux types d’analyse, de sorte à ce que chacune soit facilitée par l’autre. Pour cela, un modèle de mélange linéaire de spectres purs est utilisé pour décrire le mélange spectral puis l’image est segmentée en plusieurs groupes caractérisés par des pixels dont les abondances sont statistiquement proches. Une loi a priori est définie sur ces étiquettes de groupe sous la forme d’un champ aléatoire de Markov. Ce champ inclut classiquement un potentiel de Potts-Markov promouvant la cohérence spatiale de ces étiquettes. Il est complété par un potentiel local de site induit par la classification. Cette classification exploite la présence de données déjà labellisées par l’utilisateur. Les estimateurs bayésiens des paramètres du modèle (abondances, étiquettes de groupes, étiquettes de classes) sont approchés à l’aide d’un algorithme de Monte Carlo par chaîne de Markov. L’intérêt du modèle est illustré à l’aide d’expériences menées sur des données synthétiques et réelles., Classification and spectral unmixing are two methods to extract information from hyperspectral images. Nonetheless, it is very unusual to find a joint approach of this two complementary interpretations. In this work, a new Bayesian model is proposed to perform unmixing and classification jointly. The traditional linear mixing model is used to describe the spectral mixtures. A clustering is then performed to divide the image into spectrally coherent clusters, in which abundance vectors are statistically homogeneous. Cluster labels are assigned a Markov random field prior which assures first a spatial regularity with a Potts potential and secondly a coherence with estimated classification labels. Classification labels are finally dependent of labeled pixels provided by the user as encountered in traditional classification tasks. Performances of the model are finally assessed with synthetic and real data.

Abstract

International audience; Supervised classification and spectral unmixing are two methods to extract information from hyperspectral images. However, despite their complementarity, they have been scarcely considered jointly. This paper presents a new hierarchical Bayesian model to perform simultaneously both analysis in order to ensure that they benefit from each other. A linear mixture model is proposed to described the pixel measurements. Then a clustering is performed to identify groups of statistically similar abundance vectors. A Markov random field (MRF) is used as prior for the corresponding cluster labels. It pro-motes a spatial regularization through a Potts-Markov potential and also includes a local potential induced by the classification. Finally, the classification exploits a set of possibly corrupted labeled data provided by the end-user. Model parameters are estimated thanks to a Markov chain Monte Carlo (MCMC) algorithm. The interest of the proposed model is illustrated on synthetic and real data.

Abstract

This report presents a forward feature selection algorithm based on Gaussian mixture model (GMM) classifiers. The algorithm selects iteratively features that maximize a criterion function which can be either a classification rate or a measure of divergence. We explore several variations of this algorithm by changing the criterion function and also by testing a floating forward variation allowing backward step to discard already selected features. An important effort is made in exploiting GMM properties to implement a fast algorithm. In particular, update rules of the GMM model are used to compute the criterion function with various sets of features. The result is a C++ remote module for the remote sensing processing toolbox Orfeo (OTB) developed by CNES. Finally, the method is tested and also compared to other classifiers using two different datasets, one of hyperspectral images with a lot of spectral variables and one with heterogeneous spatial features. The results validate the fact that the method performs well in terms of processing time and classification accuracy in comparison to the standard classifiers available in OTB.

In this paper, we discuss the scientific outcomes of the 2015 data fusion contest organized by the Image Analysis and Data Fusion Technical Committee (IADF TC) of the IEEE Geoscience and Remote Sensing Society (IEEE GRSS). As for previous years, the IADF TC organized a data fusion contest aiming at fostering new ideas and solutions for multisource studies. The 2015 edition of the contest proposed a multiresolution and multisensorial challenge involving extremely high-resolution RGB images and a three-dimensional (3-D) LiDAR point cloud. The competition was framed in two parallel tracks, considering 2-D and 3-D products, respectively. In this paper, we discuss the scientific results obtained by the winners of the 2-D contest, which studied either the complementarity of RGB and LiDAR with deep neural networks (winning team) or provided a comprehensive benchmarking evaluation of new classification strategies for extremely high-resolution multimodal data (runner-up team). The data and the previously undisclosed ground truth will remain available for the community and can be obtained at http://www.grss-ieee.org/community/technicalcommittees/data-fusion/2015-ieee-grss-data-fusion-contest/. The 3-D part of the contest is discussed in the Part-B paper [1].

Abstract

International audience; Within a supervised classification framework, labeled data are used to learn classifier parameters. Prior to that, it is generally required to perform dimensionality reduction via feature extraction. These preprocessing steps have motivated numerous research works aiming at recovering latent variables in an unsupervised context. This paper proposes a unified framework to perform classification and low-level modeling jointly. The main objective is to use the estimated latent variables as features for classification and to incorporate simultaneously supervised information to help latent variable extraction. The proposed hierarchical Bayesian model is divided into three stages: a first low-level modeling stage to estimate latent variables, a second stage clustering these features into statistically homogeneous groups and a last classification stage exploiting the (possibly badly) labeled data. Performance of the model is assessed in the specific context of hyperspectral image interpretation, unifying two standard analysis techniques, namely unmixing and classification.

Abstract

Supervised classification and spectral unmixing are two methods to extract information from hyperspectral images. However, despite their complementarity, they have been scarcely considered jointly. This paper presents a new hierarchical Bayesian model to perform simultaneously both analysis in order to ensure that they benefit from each other. A linear mixture model is proposed to described the pixel measurements. Then a clustering is performed to identify groups of statistically similar abundance vectors. A Markov random field (MRF) is used as prior for the corresponding cluster labels. It pro-motes a spatial regularization through a Potts-Markov potential and also includes a local potential induced by the classification. Finally, the classification exploits a set of possibly corrupted labeled data provided by the end-user. Model parameters are estimated thanks to a Markov chain Monte Carlo (MCMC) algorithm. The interest of the proposed model is illustrated on synthetic and real data.
